Nonlinear Time Series Analysis

Worked out projects based largely on Holger Kantz and Thomas Schreiber, NONLINEAR TIME SERIES ANALYSIS, Cambridge University Press 2000 (1997). Other books and papers occasionally consulted are listed in the bibliography.

Methods are tested using artificial time series. Later we will apply the methods to real data such as EMG-recordings.

Introduction

The characteristic feature of nonlinear time series of interest here is that they look like random series although they are deterministic. The phenomenon is called deterministic chaos;

a feature which means that new analysis methods have to be developed beyond the linear classical methods which

generally "ignore" the structure behind the apparent

randomness (which may be interpreted as unwanted noise).

One of the most fundamental methodical approaches in the field of nonlinear times series analysis is the use of the delay map. Suppose we have a (scalar) discrete time series xn. Choosing a delay d and an embedding dimension m we can form delay vectors

and thus map the data in an m-dimensional embedding space.

A cluttered 1-dimensional time series may unfold as a set of clean orbits in an embedding space with appropriate choices of m and d. In fact, given a multidimensional nonlinear

dynamic system, then, in the generic case we get complete information about the system from a scalar function of the system alone by its delay map if m is large enough

(determined by the degrees of freedom of the dynamical system). This embedding result of Takens, Sauer and others is related to the classical embedding theorem by Whitehead in differential geometry (1936).

A simple case is the circle C1 which is a one-dimensional manifold. There is no one-one smooth map of C1 onto a subset U of R1.

Whereas the circle can be embedded in the 2-dimensional plane, the non-self-intersecting figure of eight needs

3-dimensional space for embedding. Whitehead proved

generally that a any smooth manifold M of dimension n can be embedded in R2n+1. The "easy" part is to show that any

smooth manifold M can be embedded in Rm for m large enough. One uses the co-ordinate patches to construct such an embedding. The "hard" part is to show that m = 2n+1 is sufficient for the embedding. This minimum dimension is though quite intuitive. A manifold M of dimension n mapped into Rm may generically intersect itself in a (2n-m)-dimensional submanifold. Indeed, if we assume that at a self-intersection point the tangent spaces of M and the self-intersection S span Rm we get m = dim(M) + dim(M) - dim(S) (from linear algebra) which gives the previous relation. Thus, for m > 2n the

self-intersection can be avoided.

The delay embedding result is also quite intuitive. Consider a continuous dynamical system determined by x(t) and its time derivatives. In a discretization of the system the time

derivatives are replaced by differences between time shifts of x; exactly this information can be obtained from appropriate delay vectors (1). The significance of the delay vector (1) is that it reveals the determinism of the system. The next point xn+1 in the time series should be determined by the delay vector (1); that is,

for some mapping F, if we denote the delay vectors by sn. One primary objective of nonlinear time series analysis is to obtain invariant characteristics of the series which will aid in the classification and identification of the source of the dynamics.

The methods for calculating the invariants must be proven to be robust; that is, the methods must produce similar results for similar data and should not be sensitive to the exact details of embedding, such as the particular choice of the co-ordinate system etc. "Proof" in the strict sense may often be hard to

obtain, so a lot of numerical experimenting with data and models is necessary. (As a case in point, it was only recently proved by W Tucker that the classical Lorenz system contains an attractor.

Incidentally his proof employs computer algorithms; see Mathematical Reviews, 2001b:27051.)

Indeed, though the theoretical foundation for nonlinear time series analysis was already apparent in the work of Poincaré around 1890, it is the computer which has made full-scale investigations of nonlinear systems feasible. Lorenz's pioneering study in 1963 was made possible by a simple computer (model Royal McBe LGP-300 which could complete one iteration per second). Also the same technology has lead to an explosive increase of data gathering in engineering and medicine. There is a pressing need to be able to gain (maximum) information from this growing amount of data.

Chaos, fractals, nonlinear systems, etc., has commanded a lot of interest in the recent decades. Besides intellectual satisfaction and new perspectives, what has these methods to show for?

Well, they may not have provided a simple shortcut to get rich by predicting prices on the stock market (hardly a deterministic system anyway...). If one settles for less one can find a number of interesting case studies which show that some of the methods can in fact work in practice. Especially medical applications are expected to benefit from nonlinear methods, since biological systems are often by nature nonlinear systems. Still, the field can be characterized as an "art"; there are as yet no automatic procedures for choosing the optimal method for a given

application. Also, some procedures announced as general tools have been later found to fail when applied to other cases etc.

One important objective of nonlinear time series analysis is to identify a time series as having a nonlinear origin in the first place. It might be that the data is better explained by classical linear methods (Auto Regression and Moving Average, ARMA).

Thus, nonlinear analysis has always to be complemented by linear analysis. Linear systems are completely described by their correlation function which is not true for nonlinear systems. That is, a distinguishing feature of nonlinear systems is that the

correlation function do not give a complete description of the system. Indeed, deterministic chaos exhibits a correlation

function typical for random processes. It is this which has made nonlinear time series analysis interesting e.g. in the biomedical field; the prospect is that what up to now has been disregarded as noise may in fact be due to a deterministic mechanism and therefore hold relevant information e.g. for diagnostic purposes.

The main outgrows from nonlinear time series analysis are new denoising and signal separation algorithms, chaos control

methods ("OGY-control"), and robust invariants for the dynamical sources (Lyapunov exponents, correlation

dimensions, Kolmogorov-Sinai entropy). Indeed, these new methods may be useful, as emphasized e.g. by Schreiber, even if the system itself cannot be unambiguously identified as a nonlinear deterministic system. The same has been true of linear methods which has been successfully applied to systems which no one thinks that they really consist of linear

ARMA-processes; but, under some conditions they behave in such a way that useful information can be obtained by these methods. -- Some basic aspects of the nonlinear themes are approached in the following worksheets.
